High-Resolution Image Synthesis with Latent Diffusion Models

2022 IEEE/CVF Conference on Computer Vision and Pattern Recognition (CVPR), 2022 · paper · AI and machine learning

Applies diffusion models in the compressed latent space of pretrained autoencoders, with cross-attention for conditioning on inputs such as text. This cuts computational cost relative to pixel-based diffusion while reporting state-of-the-art inpainting and class-conditional results and competitive performance on other tasks.

Judge's note: Checked in the images. Table 1 (p.6) gives 200-s and 4.02. Table 18 (p.28) gives 100 steps, 410K, 256M, 4.02, 0.64/0.52. Table 12 (p.24) gives Churches Nparams 294M and Iterations 500k, while CelebA-HQ is 410k. The Fig. 30 caption (p.41) gives FID 4.48 for the 'best performing model LDM-8' with 200 DDIM steps. The other datasets agree between Tables 12 and 18 (274M). No statement in the paper reconciles the step count, iteration count, parameter count or FID.

Substance Sec. 4.3.2 says the landscapes semantic-synthesis LDM uses "the latent image representation of a f = 4 model (VQ-reg., see Tab. 8)", but Table 15 (Semantic-Map-to-Image, Landscapes) lists f = 8, z-shape 32 × 32 × 4 and |Z| = 16384.

Judge's note: I checked the p.7 text and the Table 15 image on p.25. The Landscapes column reads f=8, 32×32×4, |Z|=16384, and the caption says the table covers the conditional LDMs from Sec. 4. Only one semantic-map model is listed, and the text describes no f=8 variant. D.1 / Fig. 15 discuss a KL-reg f=4 variant, which matches neither entry. Only the authors can say which configuration is correct.

Substance Eq. (16) prints the classifier-guidance update as "ε̂ ← εθ(zt, t) + √(1 − α_t²) ∇zt log pΦ(y|zt)"; under the paper's own ε-parameterisation the sign should be minus.
  • p. 18 Eq. (16)
    ˆϵ ←ϵθ(zt, t) + √(1 −α2t) ∇zt log pΦ(y|zt)

Only the authors can say what is right here.

Judge's note: Page 18 image shows a '+' in Eq. (16). Working from the paper's own definitions: Eq. (14) gives εθ = (x_t − α_t xθ)/σ_t, and the forward process is q(x_t|x_0) = N(α_t x_0, σ_t² I), so the noise scale written in Eq. 16 is σ_t = √(1−α_t²). Under this parameterisation the score is ∇ log p(x_t) ≈ −εθ/σ_t. Adding the classifier gradient to the score, score' = score + ∇ log pΦ(y|x_t), gives ε̂ = −σ_t·score' = εθ − σ_t ∇ log pΦ(y|x_t). That is a minus sign. With '+' the update moves samples away from y. The text says it is reproducing the algorithm 'as introduced in [15]'; I did not use [15]'s printed sign, only the paper's own Eqs. 14–15. The formula is wrong as printed, hence S1 and author_query.

Substance Sec. D.3 says "Our OpenImages model surpasses the results of Jahn et al [37] by a margin of nearly 11 in terms of FID", but Table 9 gives margins of 13.31 (256²) and 12.31 (512²).

Only the authors can say what is right here.

Judge's note: Table 9 (p.22) lists VQGAN+T [37] at 45.33 and 48.11 on OpenImages 256 and 512, and LDM-4 at 32.02 and 35.80. Neither margin is near 11. The COCO column (56.58 vs 40.91) gives 15.67, so no pair in the table gives about 11. Nothing elsewhere in the paper explains the figure, and only the authors can say which comparison was meant.

Substance Table 18 labels the Churches model "LDM-8 (ours, 100 steps, 410K)", but Table 12 (the models 'producing the numbers shown in Tab. 1') lists 500k iterations for LSUN-Churches. 410k is the CelebA-HQ value in Table 12.

Judge's note: Page 24 image: Table 12 gives Iterations* of 410k (CelebA-HQ), 635k (FFHQ), 500k (Churches) and 1.9M (Bedrooms); the other three agree with Table 18. Table 12's asterisk is not defined in its own caption. The similar note under Table 14 (best checkpoint used if converging early) might cover it, but the paper does not say so for Table 12. Substance Table 18, LSUN Bedrooms row "LDM-4 (ours, 200 steps, 1.9M)" lists Generator Compute 60, Classifier Compute '-', Overall Compute 55; overall is lower than the generator compute although there is no classifier.

Only the authors can say what is right here.

Judge's note: Checked the page image (p.28) and crop. The row reads 60 / - / 55. Every other row without a classifier has overall equal to generator (64/64, 18/18, 232/232, 14.4/14.4, 26/26, 79/79, 271/271), and the rows with a classifier add up (916+46=962, 79+12=91). The caption and footnotes give no other accounting rule. One of the two values is a typo, and only the authors can say which.

Judge's note: The page image and crop show 329 / 30 / 349. The other rows with a classifier add up (916+46=962; 79+12=91). The dagger says the numbers are taken from [15]. [15] is not in the files, so I cannot tell whether the mismatch comes from the source or from copying it. The row does not add up as published.

Report a problem with this finding
Reference or label In Sec. 3.3 the projection shapes do not match the products: Q = W_Q·φ_i(z_t) and V = W_V·τθ(y), but the text gives "W_V^(i) ∈ R^{d×d_ε^i}, W_Q^(i) ∈ R^{d×d_τ} & W_K^(i) ∈ R^{d×d_τ}". The shapes of W_Q and W_V appear swapped.
  • p. 4 Sec. 3.3, definitions of Q, K, V
    Q = W(i)Q · φi(zt), K = W(i)K · τθ(y), V = W(i)V · τθ(y)
  • p. 5 Sec. 3.3, continuation
    W(i)Q ∈ Rd×dτ & W(i)K ∈ Rd×dτ

Judge's note: Read on the p.4 and p.5 images. φ_i(z_t) ∈ R^{N×d_ε^i} and τθ(y) ∈ R^{M×d_τ}. W_K, which multiplies τθ(y), is given d×d_τ, so under the paper's own convention the inner dimension is the input feature dimension. On that basis W_Q, which multiplies φ_i, should be d×d_ε^i, and W_V, which multiplies τθ(y), should be d×d_τ. The printed shapes assign these the other way round. The fix is to swap the two labels.

Judge's note: E.3.5 on p.27 only covers the 5k-sample metrics for Figs. 6, 17 and 7 and the learning rates in Tabs. 13/14. Tab. 18 on p.28 gives ADM at 232 V100-days and 552M parameters, and LDM-4 at 60 (generator) / 55 (overall) V100-days and 274M parameters, which supports the ~4x claim. The two step counts for one result need clarifying. On Fig. 30 (page 41): the η = 0 captions differ from Table 1 for both CelebA-HQ (Fig. 28: 5.15 vs 5.11) and Churches (4.48 vs 4.02), while the η = 1 captions (Figs. 29, 31) match. The Sec. 4.3.1 wording "models with f ∈ {4, 8} from Sec. 4.1 in Tab. 3, Fig. 4 and Sec. D.4" is defensible: it names the f values chosen in Sec. 4.1, and LDM-8 appears in D.4/Tab. 10. Judge's note: Checked p.29 (formula, with μ̂ also summed over b,c,h,w) and the p.7 crop. Because the sums run over all indices, including channels, the estimate is one global scalar, not a per-component or per-channel variance. Judge's note: p.22 image confirms both labels: the ImageBART and VQGAN+T rows say 'acc. rate' and the caption says 'rejection rate'. Read literally, the two labels give 0.05 vs 0.95 acceptance, so the authors should clarify which is meant.

Wording Sec. F says "we train all our models on a single NVIDIA A100 GPU", while the Table 15 caption says the inpainting model "was trained on eight V100".

we train all our models on a single NVIDIA A100 GPU
  • p. 25 Table 15 caption
except for the inpainting model which was trained on eight V100

Judge's note: Page 28 and page 25 images confirm both statements. In context, Sec. F is about the Table 18 models, which do not include inpainting, so this is unqualified wording rather than a contradiction in the data.

Judge's note: The p.17 image shows the truncated expression. The earlier ELBO line (text layer line 1807) has KL(q(x_{t−1}|x_t,x_0)|p(x_{t−1}|x_t)). This is a typographical slip that does not change the derivation.
