LoRA: Low-Rank Adaptation of Large Language Models

2021 · paper · AI and machine learning

Proposes LoRA, which freezes a pretrained model's weights and trains small low-rank matrices added to each Transformer layer. For GPT-3 175B it cuts trainable parameters 10,000-fold and memory 3-fold while matching or beating full fine-tuning quality.

Checked: PDF from arxiv.org, fetched 4 Oct 2026. Page numbers are those of that PDF.

Substance Appendix D.4 lists the 37.7M LoRA budget as "(rq = rv = 8 or rq = rk = rv = ro = 2)". Table 15 gives rq = rk = rv = ro = 2 as 18.8M and rq = rk = rv = ro = 4 as 37.7M.
  • p. 20 Appendix D.4, final paragraph
    37.7M (rq = rv = 8 or rq = rk = rv = ro = 2)
  • p. 23 Table 15, LoRA rows
    rq = rk = rv = ro = 2
  • p. 23 Table 15
    rq = rk = rv = ro = 4

Judge's note: The page 20 image shows the D.4 text with "rq = rk = rv = ro = 2" under the 37.7M budget. The page 23 Table 15 lists rq=rk=rv=ro=2 at 18.8M and rq=rk=rv=ro=4 at 37.7M. The paper's formula |Θ| = 2 × L̂_LoRA × d_model × r, with 96 layers and d_model = 12288, gives the same result. The rank in the D.4 text should be 4.

Substance Appendix G gives φ(A,B,i,j) = Σσi²/p = "1/p (1 − d(U_A^i, U_B^j)²)". With d² = p − Σσi², the right-hand side should be 1 − d²/p, that is (1/p)(p − d²).
  • p. 24 Appendix G, definition of φ
    = 1/p (1 − d(U i A, U j B)2)
  • p. 23 Appendix G, Projection Metric definition
    d(U i A, U j B) = sqrt(p − Σ σi²)
  • p. 23 Appendix G, Projection Metric
    d(U i A, U j B) = sqrt(p − Σ σ2 i)
  • p. 24 Appendix G, final equation
    = 1/p (1 − d(U_A^i, U_B^j)^2)

Only the authors can say what is right here.

Judge's note: The page 23 image defines d = sqrt(p − Σ_{i=1}^p σi²). The page 24 image shows 1/p multiplying (1 − d(U_A^i,U_B^j)²). My own working: Σσ² = p − d², so Σσ²/p = (p − d²)/p. This equals (1 − d²)/p only when p = 1. Counterexample: identical spans give d = 0, so the printed form gives 1/p, but the next sentence says φ = 1. The definition φ = Σσ²/p and the stated properties still hold; only the final equality is wrong as printed.

Reference or label Figure 3 title reads "φ(Ar=64, Ar=8, i, j)" while Eq. (4) defines φ(Ar=8, Ar=64, i, j) with i (1–8) indexing Ar=8; the heatmap axes follow Eq. (4).
  • p. 11 Figure 3 title above heatmaps
    φ(Ar=64, Ar=8, i, j)
  • p. 11 Equation (4)
    φ(Ar=8, Ar=64, i, j)

Judge's note: Page 11 image: the title above the heatmaps has A_{r=64} first. The axes show i from 1 to 8 and j up to 58/64, which matches Eq. (4) and the caption ('column vectors of A_{r=8} and A_{r=64}'). The first two arguments of the title are swapped.

Reference or label Inside Appendix D.4 (GPT-3), the text says "See Section D.4 for more details on the hyperparameters used.", so the section points to itself.
  • p. 20 Appendix D.4 (GPT-3), continued text
See Section D.4 for more details on the hyperparameters used.

Judge's note: The text layer shows the D.4 GPT-3 heading at the bottom of page 19. The paragraph continues onto page 20, where the sentence appears, and no new heading comes before it. The pointer is therefore circular. The hyperparameters are in Table 12, which the paragraph names two sentences later.

Wording PrefixLayer counts in Table 15 and D.4 (e.g. "20.2 M" for lp=8, li=8) do not follow the stated formula "|Θ| = L × dmodel × (lp + li)", which gives 18.9M with L=96 and d_model=12,288.

  • p. 20 Appendix D.4

Only the authors can say what is right here.

Judge's note: The paper uses 96 layers and d=12,288. With these values, the PrefixEmbed (3.2M) and LoRA (4.7M) counts reproduce exactly, but the PrefixLayer counts do not: 4.7 vs 5.1, 9.4 vs 10.1, 18.9 vs 20.2, 42.5 vs 44.1 and 75.5 vs 76.1. The excess is neither a constant offset nor a constant ratio. The paper gives no explanation, such as extra reparametrisation parameters.

Elsewhere in these tables, parameter counts are truncated or rounded consistently (354.92M→354M, 11.09M→11M). By either rule, 25.19M gives 25M, not 24M. I found no explanation in the text. • p. 4 Table 1 caption
We use an NVIDIA Quadro RTX8000.

Judge's note: Page 5 has the V100 statement. The Table 1 caption on page 4 and Appendix B (text line 1317) name the RTX8000. 'All experiments' probably means the task-performance experiments, but as worded it overstates.

Wording Section 4.2 claims "a 25% speedup during training", but footnote 5 gives throughputs of 32.5 vs 43.1 tokens/s per V100, which is a 33% throughput gain (25% matches only a reduction in time).

Only the authors can say what is right here.

Wording Section 7 says GPT-3 175B is where "we achieved the largest reduction of trainable parameters (up to 10,000×)", yet Table 4 pairs 175,255.8M (FT) with 4.7M (LoRA), a ratio of about 37,000×.

Judge's note: Checked p9 Section 7 and Table 4 (p8). The 10,000× figure matches the checkpoint-size reduction for the 18M configuration (350GB to 35MB, Section 4.2) and the abstract's '10,000 times'. As an upper bound ('up to'), it is below the paper's own smallest-budget ratio. This is a wording point: the figure reads as an order of magnitude and understates rather than overstates.

  • p. 23 Table 15, PrefixEmbed lp = 32, li = 8
    0.4 M

Judge's note: The formula |Θ| = d_model × (lp + li) is in Section 5.1. The other PrefixEmbed rows are rounded, not truncated: 0.885→0.9 and 1.67→1.7. The 0.4 M entry is inconsistent with that convention.

Typo The Table 16 caption reads "LoRA performs exhibits favorable sample-efficiency", with a duplicated verb.
  • p. 23 Table 16 caption
    LoRA performs exhibits favorable sample-efficiency

Judge's note: I checked the page 23 image. The caption is as quoted.

Typo Table 17's Adaptation-Specific rows use the label "PrefixTune" (lp = li = 8), whereas the same table's learning-rate rows and Table 16 call the method "PrefixLayer".
  • p. 24 Table 17, Adaptation-Specific rows
    PrefixTune

Judge's note: I checked the page 24 image. The label is inconsistent with the rest of the table, but lp = li = 8 makes clear that it means PrefixLayer.
